Adversarial Robustness Evaluation of Deep Neural Networks Under Perturbed Input Conditions

Abstract Deep neural networks achieve strong predictive performance across image-recognition tasks, yet high accuracy on unmodified inputs does not necessarily imply stability when inputs are perturbed. Small, carefully structured changes can alter network predictions even when the semantic content of an image remains conceptually unchanged. Adversarial robustness evaluation therefore examines whether model performance remains stable within explicitly defined perturbation conditions rather than relying exclusively on conventional test accuracy. This hypothetical methodological study evaluates three deep neural-network configurations under clean and perturbed image conditions: a conventional convolutional neural network, a residual convolutional architecture, and an adversarially trained residual model. A fictional dataset containing 10,000 images across ten recognition categories is divided into training, validation, and independent testing subsets. Perturbation evaluation includes bounded single-step, iterative bounded, transferred, and non-adversarial noise conditions.
The illustrative analysis shows that conventional models maintain strong clean-data accuracy but experience substantial performance deterioration under structured perturbations. The adversarially trained model records slightly lower clean accuracy but substantially stronger hypothetical robust accuracy. A second analysis evaluates the robust model under progressively stronger perturbation conditions and demonstrates a gradual decline in accuracy, precision, recall, and F1 score as perturbation severity increases. The study concludes that adversarial robustness should be evaluated through multiple perturbation families, clearly defined threat assumptions, clean-data performance, and robustness-specific metrics. Apparent robustness against one evaluation method cannot establish general robustness. Reliable assessment requires diverse stress testing, avoidance of gradient masking, transparent reporting of perturbation constraints, and independent evaluation procedures.
